This skill\ncovers operating a vector database day to day — configuring the index\ncorrectly for its workload, scaling it horizontally (sharding) and for\navailability (replication), and tuning upsert and query performance — with\nconcrete, comparable guidance across the three most common choices\n(Pinecone as a managed service, Weaviate and Milvus as commonly\nself-hosted or managed alternatives). It assumes the index schema and\ndimension are already correct and validated (see\n[vector-database-configuration-validation](../vector-database-configuration-validation/SKILL.md))\nand that data is already flowing in via an ingestion pipeline (see\n[vector-database-ingestion-pipeline-for-rag](../vector-database-ingestion-pipeline-for-rag/SKILL.md));\nthis skill is specifically the operate-and-tune layer underneath a RAG\nsystem's retrieval stage (see\n[rag-pipeline-design](../rag-pipeline-design/SKILL.md) for the retrieval\npattern itself, which this skill doesn't repeat).\n\n## When to use\n\n- Standing up a new vector index/collection in Pinecone, Weaviate, or\n  Milvus and choosing its core configuration.\n- Query latency has degraded as the corpus or query volume has grown, and\n  it needs concrete tuning, not just \"add more hardware.\"\n- Deciding how to shard or partition a large corpus (by tenant, by data\n  recency, by content type) across index namespaces/collections.\n- Setting up replication for read throughput or availability during\n  upgrades/maintenance.\n- Upserts are slow, timing out, or backing up during a bulk load or a\n  re-indexing run.\n- Capacity planning before a corpus grows significantly (more documents,\n  more tenants, higher QPS).\n\n## Prerequisites & environment\n\n- A known embedding dimension and distance metric already fixed for the\n  corpus (changing either requires a full re-embed and a new index, not a\n  config tweak — see\n  [vector-database-configuration-validation](../vector-database-configuration-validation/SKILL.md)).\n- Estimated corpus size (vector count), expected query QPS, and expected\n  write (upsert) rate — sizing decisions below depend on having real\n  numbers, not guesses.\n- For Pinecone: an account with pod-based or serverless index access\n  (capacity/scaling mechanics differ between the two — check current\n  Pinecone documentation for which applies to your plan, since this has\n  changed over time).\n- For Weaviate/Milvus: a self-hosted or managed cluster with enough nodes\n  to support the replication/sharding plan you choose — these are\n  self-operated systems, so cluster sizing is your responsibility in a way\n  it isn't with a fully managed Pinecone index.\n- Monitoring for index-level metrics (query latency, upsert throughput,\n  index/memory fullness) wired to a dashboard — see\n  [prometheus-and-grafana-monitoring-stack](../../../observability-and-platform-extras/skills/prometheus-and-grafana-monitoring-stack/SKILL.md)\n  for the metrics-pipeline mechanics if self-hosting Weaviate/Milvus.\n\n## Step-by-step guidance\n\n1. **Configure the index's core parameters deliberately, not with\n   defaults.** All three support HNSW as the common ANN (approximate\n   nearest neighbor) index type; Milvus additionally supports IVF-family\n   indexes, which trade some recall for lower memory at very large scale.\n   Confirm the distance metric matches what the embedding model expects\n   (cosine similarity is the common default; some models are tuned for dot\n   product) — a mismatch here degrades relevance silently, not with an\n   error (see\n   [vector-database-configuration-validation](../vector-database-configuration-validation/SKILL.md)\n   for the validation gate on this specifically).\n\n2. **Tune HNSW's core knobs deliberately — they trade recall, latency, and\n   memory against each other:**\n   - `M` (max connections per node): higher improves recall, increases\n     memory and index build time. Common starting range: 16-32.\n   - `ef_construction` (candidate list size during index build): higher\n     improves recall at index-build-time cost only (a one-time or\n     per-upsert cost, not a per-query cost). Common starting range:\n     100-200.\n   - `ef_search` (candidate list size at query time): higher improves\n     recall at direct query-latency cost, tunable per query without\n     rebuilding the index. This is usually the first knob to adjust when\n     tuning the recall/latency trade-off after launch.\n\n   ```yaml\n   # Weaviate collection config (illustrative — verify field names against\n   # your Weaviate version's current API)\n   vectorIndexConfig:\n     distance: cosine\n     ef: 128            # ef_search, tunable post-launch\n     efConstruction: 128\n     maxConnections: 32  # M\n   ```\n   ```python\n   # Milvus index params (illustrative)\n   index_params = {\n       \"index_type\": \"HNSW\",\n       \"metric_type\": \"COSINE\",\n       \"params\": {\"M\": 24, \"efConstruction\": 200},\n   }\n   search_params = {\"ef\": 128}  # tuned separately at query time\n   ```\n   ```python\n   # Pinecone: HNSW internals are managed for you on pod-based indexes;\n   # the primary tunable is pod type/size and top_k at query time rather\n   # than raw M/ef parameters — check current Pinecone docs for what's\n   # exposed on your index type (pod-based vs. serverless).\n   ```\n\n3. **Shard/partition the corpus deliberately, not by default.** Options\n   map roughly across vendors:\n   - **Pinecone namespaces**: logical partitions within one index, common\n     for per-tenant isolation in a multi-tenant application — queries are\n     scoped to one namespace at a time.\n   - **Weaviate multi-tenancy / sharding**: dedicated tenant partitions\n     within a collection, or manual sharding across multiple collections\n     for very large single-tenant corpora.\n   - **Milvus partitions within a collection**: similar per-tenant or\n     per-category logical split; Milvus also supports sharding a\n     collection across multiple query nodes for horizontal scale.\n\n   Partition by **tenant** when the workload is naturally multi-tenant\n   (each query only ever needs one tenant's data — this also gives you\n   access-control isolation for free). Partition by **data recency or\n   category** when queries are commonly scoped that way (e.g. \"search only\n   this year's documents\") — this reduces the search space per query\n   directly rather than relying on a metadata filter over an unpartitioned\n   index.\n\n4. **Configure replication for both availability and read throughput.**\n   Pinecone (pod-based) supports replica pods that both increase query\n   throughput and provide failover; Weaviate and Milvus support a\n   configurable replication factor per collection/shard. Set replication\n   high enough to survive a node loss during a rolling upgrade without a\n   query-serving gap, not just to hit an arbitrary throughput number.\n\n   ```yaml\n   # Milvus collection replication (illustrative)\n   collection: product_docs\n   replica_number: 2   # survives one query-node loss without downtime\n   ```\n\n5. **Tune upsert (write) performance separately from query performance —\n   they compete for the same resources.** Batch upserts rather than\n   single-vector calls (all three vendors expose a batch upsert API);\n   tune batch size empirically (too small wastes round-trips, too large\n   risks request timeouts or memory pressure on the server side). Avoid a\n   single hot partition/shard absorbing all writes during a bulk load —\n   spread a large backfill across partitions/time rather than one burst\n   against one shard.\n\n   ```python\n   # Generic batch-upsert pattern applicable across vendors' SDKs\n   BATCH_SIZE = 200\n   for batch in chunked(vectors_with_metadata, BATCH_SIZE):\n       index.upsert(vectors=batch, namespace=tenant_id)\n   ```\n\n6. **Tune query performance with pre-filtering vs. post-filtering in\n   mind.** When a query combines a vector search with a metadata filter\n   (e.g. \"only documents from `product_line=payments`\"), check whether\n   your vendor/index applies the filter *before* the ANN search\n   (pre-filtering, generally more accurate and often faster when the\n   filter is selective) or *after* (post-filtering the ANN result set,\n   which can silently return fewer results than `top_k` if the filter\n   excludes most of the initial candidates). This behavior differs by\n   vendor and by whether the filtered field is indexed — verify against\n   current documentation for your specific setup rather than assuming.\n\n7. **Size capacity with an explicit formula, not a guess.** A rough\n   working estimate for HNSW memory footprint:\n\n   ```\n   memory_per_vector ≈ (dimension × bytes_per_dim) × (1 + hnsw_overhead_factor)\n   total_memory ≈ memory_per_vector × vector_count + metadata_overhead\n   ```\n\n   `bytes_per_dim` is typically 4 (float32) unless the vendor supports\n   quantization (e.g. lower-precision or product-quantized storage, which\n   trades some recall for meaningfully lower memory — check whether your\n   chosen vendor supports it and at what recall cost before assuming free\n   savings). Re-check actual per-vendor overhead figures against current\n   documentation before finalizing a sizing decision — don't treat the\n   formula's constant as vendor-verified without confirming.\n\n8. **Monitor operational metrics continuously, not just at launch**: query\n   latency (p50/p95), upsert throughput and error rate, index/memory\n   fullness relative to the tier or node's capacity, and (for\n   replicated setups) replica lag. Alert on index fullness well before\n   the hard ceiling — performance commonly degrades before an index is\n   literally full, not only at 100%.\n\n9. **Plan backup/restore and index migration as a first-class operation,\n   not an afterthought.** Snapshot/export support differs by vendor —\n   confirm your chosen vendor's current backup mechanism and test a\n   restore before you need it for real.
